다변량 시계열 예측은 전력, 교통과 같은 분야에서 비용 절감 및 체증 해소 등의 이점을 가져다주기에 필수적이다. 다변량 시계열 예측에서 좋은 성능을 달성하기 위해서는 각 변수 내의 시간적 패턴과 변수 간의 관계를 의미하는 공간적 패턴을 정확하게 해석하는 것이 중요하다. 최근에는 이 두가지 패턴을 학습하여 예측에 이용하는 그래프 신경망(GNN) 모델들이 많은 주목을 받았다. 그러나 기존 GNN 모델들은 시간적 패턴의 다중주기성 특징을 추출하는 데에 어려움이 있어 예측 모델이 특정 주기에 편향될 수 있다는 문제점이 있다. 또한, 그들은 시간에 따라 변하는 공간적 패턴을 능동적으로 반영하지 못한다. 따라서 본 논문에서는 앞에서 말한 두 한계를 해결하기 위한 다변량 시계열 예측을 위한 GNN 모델을 제안한다. 제안 모델은 멀티스케일 확장 컨볼루션 모듈과 입력 적응형 그래프 생성 모듈로 구성되어 있다. 전자는 다중주기성 특징을 반영하기 위해 각 스케일에 대한 시간적 특징을 추출한다. 후자는 인접 행렬을 능동적으로 생성하기 위해 과거와 현재의 시간적 특징을 동시에 고려하여 인접 행렬을 생성한다. 최종 예측값은 각 스케일 별로 생성된 시간적 특징과 인접 행렬을 모두 통합하여 도출한다. 제안 모델을 평가하기 위해 기존 다변량 시계열 예측 모델들과 4가지 데이터셋에 대해서 성능을 비교한 결과, 제안하는 모델은 기존 state-of-the-art 모델에 비해 RRSE 평가 지표에서 최대 4.4%의 성능 향상을 보였다.
Multivariate time series forecasting (MTSF) is essential in fields such as electricity and traffic since it can reduce operation costs and congestions. To achieve good accuracy in MTSF, it is important to precisely interpret the temporal patterns within each variable and spatial patterns between the variables. Recently, graph neural network (GNN) models received attention as they are capable to combine these two patterns. However, existing GNN models have difficulty in extracting multiperiodic characteristics from temporal patterns, which can make a model be biased to a specific scale. Also, they have limitations in reflecting the dynamic spatial patterns that change over time. Therefore, in this paper, we propose a novel GNN model for MTSF that solves the two aforementioned limitations. The proposed model consists of two main modules: the multi-scale dilated convolution module and the input-adaptive graph construction module. The former module extracts the temporal features for each scale to reflect the multiperiodic characteristics. The latter module dynamically generates the adjacency matrix by considering the historical and current temporal features simultaneously. We conduct the final prediction by integrating the obtained scale-wise temporal features and adjacent matrices. Through comparison with the existing MTSF models on four real-world datasets, our proposed model showed up to 4.4% performance improvement in terms of RRSE over existing state-of-the-art model.
