Non-intrusive reduced-order modeling method based on proper orthogonal decomposition (POD) and polynomial chaos expansion (PCE) are developed for stochastic representations in the context of uncertainty quantification (UQ). We first propose a POD-PCE based non-intrusive reduced-order modeling for the steady-state parameterized problems. In this method, POD provides an optimally ordered basis from a set of selected full-order snapshots. Truncating this optimal basis, we construct a reduced-order model with undetermined coefficients. Then, PCE is utilized to approximate the coefficients of the truncated basis. In the proposed method, we construct a PCE using a non-intrusive regression-based method. Combined with the model reduction ability of POD, this makes the proposed method a powerful tool for stochastic representations in UQ analysis. To investigate the performance of the proposed method, we provide three numerical examples, i.e., a highly nonlinear analytical function with three uncertain parameters, two-dimensional (2-D) heat-driven cavity flow with a stochastic boundary temperature, and 2-D heat diffusion with stochastic conductivity. The results demonstrate that the proposed method significantly reduces the computational costs and storage requirements that arise due to high-dimensional physical and random spaces. While demonstrating a similar accuracy with that of the classical full-PCE in predicting statistical quantities. Furthermore, the proposed method reasonably predict the outputs of the full order model using only a few snapshots. Based on the POD-PCE method, we further analyze the sensitivity of model outputs to the input variables using global sensitivity analysis (GSA). The GSA is performed based on the vector projection-based sensitivity indices (VPSIs), which are powerful measures of the comprehensive effects of model inputs on multiple outputs, but are conventionally estimated by Monte Carlo simulations (MCS) that incur prohibitive computational costs for many practical problems . In the method proposed here, the VPSIs are efficiently estimated via two polynomial chaos-based surrogates: PCE and POD-PCE. Several numerical examples with various types of outputs are tested to validate the proposed method, and the results demonstrate that the polynomial chaos-based surrogates are more efficient than MCS at estimating the sensitivity indices, even for models with a large number of outputs. Furthermore, for models with only a few outputs, PCE alone is preferable, whereas for models with a large number of outputs, POD-PCE is the best approach. Finally, we extend the POD-PCE to the time-dependent parameterized problems. The new method is called spatio-temporal POD-PCE, in which, POD is first used to extract the spatial modes, POD-PCE is then used to approximate the projection coefficients of the spatial modes. Naturally, this method can be used to evaluate the sensitivity indices in GSA as the original POD-PCE for steady-state parameterized problems. Furthermore, 1-D interpolation methods can be used to evaluate the temporal modes at any given time instant. Combing with the spatial modes and the PCE of the parameter dependent coefficients, one can easily evaluate the model outputs using the reduced-order model at given time instants in the considered time domain, leading to a reduction of computational complexity. To validate the numerical performance of the spatio-temporal POD-PCE, three time-dependent parameterized problems are tested; i.e., 1-D viscous Burger's equation with random diffusion coefficient, 2-D incompressible fluid flow over cylinder with random inflow boundary condition and 1-D force Burger's equation with random force term. The results indicate that the proposed method is able to approximate the full-order model at a very cheap cost with a reasonable loss of accuracy. Furthermore, the proposed method is effectiveness in the estimation of low order moments, indicating a great potential in the UQ analysis for time-dependent problems.
본 연구는 불확실성 정량화 (UQ)의 확률적 표현을 위해 적절한 직교 분해 (Proper Orthogonal Decomposition, POD) 및 다항식 카오스 확장 (Polynomial Chaos Expansion, PCE)에 기반한 비관입 저차수화 모델링에 관한 것입니다. 먼저, 정상 상태의 매개 변수화된 문제에 대해 POD-PCE 기반의 비관입 저차수화 모델링을 제안합니다. 본 연구에 사용된 POD를 활용하여, 샘플 데이터에 대한 최적의 정렬된 기저를 구합니다. 최적 기저 함수를 근간으로 차수 저감된 모델을 미정계수를 활용하여 구성합니다. 그런 다음, PCE를 사용하여 절단된 기저함수의 계수를 근사화합니다. 제안 된 방법에서는 비관입 회귀 기반 PCE를 구성합니다. 그러므로 제안된 방법은 POD의 저차수화 모델링에 의해, UQ 분석의 확률적 표현에 매우 유용하다는 것을 알게 되었습니다. 제안 된 방법의 성능을 조사하기 위해, 다음의 3가지 수치 문제를 고려하였습니다. 1) 3개의 불확실 매개 변수를 갖는 고차 비선형 해석 함수, 2) 확률적 경계 온도를 갖는 2차원 열-구동 (Thermally-driven) 공동 흐름 문제, 3) 2차원 확률분포를 갖는 열전도계수에 따른 열 확산 문제. 본 논문에서 제안된 방법을 사용함으로써, 고차 물리 및 랜덤 함수 공간으로 인해 발생하는 계산 비용 및 저장 요구 사항이 상당히 감소시킬 수 있다는 것이 확인되었습니다. 반면, 제안된 방법은 통계량을 예측할 때, full-PCE 와 비슷한 정확도를 유지하며, 소수의 데이터를 사용하여, 전체 모델의 결과를 합리적으로 예측합니다. POD-PCE 방법을 기반으로 전제적 민감도 분석 (Global Sensitivity Analysis, GSA)을 수행하여, 입력 변수에 대한 모델 출력의 민감도를 분석하였습니다. GSA는 모델 입력이 여러 출력에 미치는 포괄적인 효과를 측정하는 벡터 투영 기반 민감도 지수 (Vector Projection Sensitivity Index, VPSI)를 기반으로 수행됩니다. 그러나, 통상적으로 몬테카를로 시뮬레이션 (Monte Carlo Simulations, MCS)에 의해 추정되어 엄청난 계산 비용이 소요됩니다. 본 연구에서는 보다 일반적인 문제에 대해 VPSI의 추정을 위해, PCE 혹은 POD-PCE를 통해 효율적으로 추정하였습니다. 이에 대한 제안된 방법의 유효성을 검증하기 위해, 다양한 유형의 출력을 갖는 여러 예제에 대한 수치해석이 수행되었습니다. 그 결과, 많은 수의 출력이 있는 모델의 경우에 대해, PCE 기반 대리모델의 민감도 지수를 추정이 MCS 보다 효율적임을 확인하였습니다. 아울러, 출력이 적은 모델의 경우 PCE만 사용하는 것이 좋지만 출력이 많은 모델의 경우 POD-PCE가 가장 효율적임을 알 수 있습니다. 마지막으로 POD-PCE 기법에 대한 모델링을 시간에 따른 매개 변수화된 문제까지 확장하였습니다. 이에, 시공간 (Spatio-temporal) POD-PCE 기법을 새롭게 제안합니다. 먼저, POD를 사용하여 공간 모드를 추출하였으며, POD-PCE를 통해 공간 모드의 투영 계수를 근사화 하였습니다. 그 다음, 1차원 보간법을 사용하여, 주어진 시간 순간의 시간 모드를 평가하였습니다. 인자에 의존하는 계수의 공간 모드 및 PCE 와 함께, 고려된 시간 영역에서 주어진 시간 순간이 저차수화된 모델링을 사용하여 모델 출력을 쉽게 평가할 수 있었으며, 계산 복잡성을 완화시켰습니다. 시공간 POD-PCE의 수치적 성능을 검증하기 위해, 1) 임의 확산 계수를 갖는 1차원 점성 Burgers 방정식, 2) 임의 유입 경계 조건을 갖는 2차원 비압축성 실린더 후류, 3) 무작위 힘 항을 갖는 1차원 Burgers 방정식에 대한 수치 연구를 수행하였습니다. 그 결과, 제안된 방법은 합리적인 수준의 오차를 나타내지만, 매우 저렴한 비용으로 Full-order 모델을 근사할 수 있음을 확인하였습니다. 아울러, 제안된 방법은 시간 변화를 수반하는 모델에 대한 UQ 분석에 매우 유용하며, 특히 저차 모멘트 추정에 매우 효과적임을 확인하였습니다.
